基于YOLOv8n的改进河湖“四乱”轻量型遥感目标检测算法
Improved Lightweight Remote Sensing Object Detection Algorithm for River and Lake“Four Chaos” Based on YOLOv8n
[Objective] Remote sensing images of river and lake scenes are characterized by dense small objects, complex backgrounds, and diverse target scales, which require models with both precise feature extraction capability and lightweight efficiency. This study develops a lightweight remote sensing object detection algorithm based on YOLOv8n, named FBL-YOLO, to achieve a balance between detection accuracy and model efficiency while meeting the real-time detection requirements of mobile devices for the supervision of river and lake “four chaos”. [Methods] FBL-YOLO achieved three-level architectural optimization based on the YOLOv8n framework. (1) Backbone optimization: The bottleneck structure in the C2f module of YOLOv8n was replaced with an improved FasterNet unit to construct the FasterC2f lightweight feature extraction module. (2) Neck optimization: A BIMAFPN structure was designed by integrating the advantages of multi-branch auxiliary feature pyramid network (MAFPN) and bidirectional feature pyramid network (BiFPN). (3) Head optimization: A lightweight shared convolutional detection head (LSCD) was introduced, which employed shared convolution mechanisms to capture multi-scale image information uniformly. Experimental evaluations were performed on both a self-built river and lake “four chaos” dataset (3 311 images and 6 958 suspected issue patches, covering three categories: illegal construction, occupation, and stacking) and the public NWPU VHR-10 dataset. [Results] (1) Ablation experiments: Compared with the baseline YOLOv8n, FBL-YOLO integrating all three modules achieved a 50% reduction in parameter count (from 3.01 MB to 1.5 MB) and a 33.3% reduction in FLOPs (from 8.1 GB to 5.4 GB), with mAP50 increasing by 2.8% (from 56.1% to 58.9%). (2) Category-specific performance: FBL-YOLO showed significant improvements in detecting small and complex targets. The mAP50 for “illegal stacking” (small and scattered targets) increased by 8.4 percentage points (from 24.5% to 32.9%), and that for “illegal occupation” improved by 1.6 percentage points (from 69.7% to 71.3%), while that for “illegal construction” decreased slightly by 1.5 percentage points. (3) Comparison with state-of-the-art algorithms: FBL-YOLO outperformed other lightweight models (e.g., YOLOv5n, YOLOv9t, YOLOv10n, NanoDet-Plus, PP-PicoDet) in overall performance, achieving the highest mAP50 (58.9%) with the smallest parameter count (1.5 MB). (4) Generalization performance: On the NWPU VHR-10 dataset, FBL-YOLO achieved an overall mAP50 of 90.2%, which was 5.6 percentage points higher than that of YOLOv8n. Significant improvements were observed in categories such as storage tanks and ground track fields, verifying its strong cross-scene adaptability. [Conclusion] The proposed FBL-YOLO algorithm effectively balances detection accuracy and model compactness through three-level optimization of the backbone, neck, and head. It reduces the parameter size and computational complexity by 50% and 33.3%, respectively, while improving mAP50 by 2.8% on the self-built river and lake “four chaos” dataset, particularly enhancing the detection performance for small targets such as “illegal stacking”. Its excellent performance on the NWPU VHR-10 dataset further confirms its generalization capability. FBL-YOLO meets the real-time deployment needs of mobile terminals in grassroots inspections, providing technical support for automated supervision of river and lake “four chaos”. Future research should focus on improving robustness under extreme weather conditions, exploring multimodal data fusion, and realizing real-time model updates at the edge to support comprehensive watershed management.

SMD (Singapore Maritime Dataset) is a public dataset with annotated videos, and it is almost unique in the training of deep neural networks (DNN) for the recognition of maritime objects. However, there are noisy labels and imprecisely located bounding boxes in the ground truth of the SMD. In this paper, for the benchmark of DNN algorithms, we correct the annotations of the SMD dataset and present an improved version, which we coined SMD-Plus. We also propose augmentation techniques designed especially for the SMD-Plus. More specifically, an online transformation of training images via Copy & Paste is applied to solve the class-imbalance problem in the training dataset. Furthermore, the mix-up technique is adopted in addition to the basic augmentation techniques for YOLO-V5. Experimental results show that the detection and classification performance of the modified YOLO-V5 with the SMD-Plus has improved in comparison to the original YOLO-V5. The ground truth of the SMD-Plus and our experimental results are available for download.

Traditional camera sensors rely on human eyes for observation. However, human eyes are prone to fatigue when observing objects of different sizes for a long time in complex scenes, and human cognition is limited, which often leads to judgment errors and greatly reduces efficiency. Object recognition technology is an important technology used to judge the object’s category on a camera sensor. In order to solve this problem, a small-size object detection algorithm for special scenarios was proposed in this paper. The advantage of this algorithm is that it not only has higher precision for small-size object detection but also can ensure that the detection accuracy for each size is not lower than that of the existing algorithm. There are three main innovations in this paper, as follows: (1) A new downsampling method which could better preserve the context feature information is proposed. (2) The feature fusion network is improved to effectively combine shallow information and deep information. (3) A new network structure is proposed to effectively improve the detection accuracy of the model. From the point of view of detection accuracy, it is better than YOLOX, YOLOR, YOLOv3, scaled YOLOv5, YOLOv7-Tiny, and YOLOv8. Three authoritative public datasets are used in these experiments: (a) In the Visdron dataset (small-size objects), the map, precision, and recall ratios of DC-YOLOv8 are 2.5%, 1.9%, and 2.1% higher than those of YOLOv8s, respectively. (b) On the Tinyperson dataset (minimal-size objects), the map, precision, and recall ratios of DC-YOLOv8 are 1%, 0.2%, and 1.2% higher than those of YOLOv8s, respectively. (c) On the PASCAL VOC2007 dataset (normal-size objects), the map, precision, and recall ratios of DC-YOLOv8 are 0.5%, 0.3%, and 0.4% higher than those of YOLOv8s, respectively.

Real-time object detection based on UAV remote sensing is widely required in different scenarios. In the past 20 years, with the development of unmanned aerial vehicles (UAV), remote sensing technology, deep learning technology, and edge computing technology, research on UAV real-time object detection in different fields has become increasingly important. However, since real-time UAV object detection is a comprehensive task involving hardware, algorithms, and other components, the complete implementation of real-time object detection is often overlooked. Although there is a large amount of literature on real-time object detection based on UAV remote sensing, little attention has been given to its workflow. This paper aims to systematically review previous studies about UAV real-time object detection from application scenarios, hardware selection, real-time detection paradigms, detection algorithms and their optimization technologies, and evaluation metrics. Through visual and narrative analyses, the conclusions cover all proposed research questions. Real-time object detection is more in demand in scenarios such as emergency rescue and precision agriculture. Multi-rotor UAVs and RGB images are of more interest in applications, and real-time detection mainly uses edge computing with documented processing strategies. GPU-based edge computing platforms are widely used, and deep learning algorithms is preferred for real-time detection. Meanwhile, optimization algorithms need to be focused on resource-limited computing platform deployment, such as lightweight convolutional layers, etc. In addition to accuracy, speed, latency, and energy are equally important evaluation metrics. Finally, this paper thoroughly discusses the challenges of sensor-, edge computing-, and algorithm-related lightweight technologies in real-time object detection. It also discusses the prospective impact of future developments in autonomous UAVs and communications on UAV real-time target detection.
